Endpoint Candidates enhance inference evaluation by allowing users to test deployments against production traffic, optimizing for latency and cost.

Optimizing Inference with Endpoint Candidates for Performance Evaluation

Modern inference engineering fundamentally revolves around minimizing latency, maximizing throughput, and optimizing costs. To achieve these metrics, reliable testing and measurement become crucial components in the process.

With a focus on enhancing inference performance, tools like Endpoint Candidates have emerged as valuable assets for developers. These tools allow for the evaluation of different deployments, helping teams test and compare various metrics without the overhead of manually setting up traffic-mirroring infrastructure.

Understanding Endpoint Candidates

Endpoint Candidates provide a framework for creating alternative deployments within your inference architecture. This functionality enables users to assess the potential impact of different models and configurations on quality, latency, throughput, and cost. Each Candidate can simulate production conditions by handling a portion of the actual traffic while Modal manages the underlying infrastructure. Promoting a Candidate to production can be executed seamlessly from a centralized dashboard.

Within this environment, users can evaluate the performance of new model checkpoints or even completely different models without the complexity of replicating traffic management and deployment systems. Notably, Edge Cases are generally accessible across all Modal workspaces, enhancing flexibility and usability in performance testing.

Getting Started with Candidates

To initiate a new Candidate setup, start by selecting an existing Dedicated Endpoint within your Modal environment. By choosing the Create candidate option, you have the ability to select an existing model from Modal’s catalog or utilize weights from repositories like Hugging Face.

After configuring your Candidate, the next step involves setting up traffic mirroring. This allows a portion of the live traffic to be duplicated and sent to the Candidate, enabling you to gauge its performance in real time. The production system continues to process original requests, ensuring users experience consistent service while you assess the Candidate's behavior.

Using the dashboard, you can monitor various metrics associated with the Candidate, such as latency and throughput. This also includes running performance benchmarks to analyze how the Candidate performs under varying load conditions. Each Candidate is assigned a unique URL, allowing you to execute existing quality assessments against it easily.

Managing Production Stability

A significant challenge in implementing traffic mirroring is preventing slower candidates from delaying production. When multiple Candidates receive data from a large request, they can process it at different rates. To mitigate this, Modal’s architecture incorporates a refined proxying mechanism that forks each request stream into separate bounded buffers for each active Candidate. This setup allows each Candidate to read independently. If one buffer becomes full, the system can cancel that mirrored request while keeping production—along with other mirrors—operational.

Additionally, to address the concurrent demand posed by numerous requests, Modal has capped the amount of data each proxy process can mirror. By sharing request-body chunks across processes, the system economizes on memory usage, ensuring that the infrastructure remains efficient even under heavy load.

The mirroring process is designed to prioritize production efficiency, making mirrored requests on a best-effort basis. This design choice means that under high demand, mirrored requests may be dropped, thus allowing production to proceed without being held back by slower candidates.

Future Enhancements

Looking ahead, Modal is committed to expanding the capabilities of Endpoint Candidates. This includes greater control over where compute tasks are placed and enhanced metrics for analyzing performance across deployments. Teams are also working on automating experimentation with inference optimizations, building on the features introduced with Auto Endpoints.

Endpoint Candidates provide a testing ground for optimizing inference infrastructure effectively. By facilitating controlled experimentation on live traffic, Modal enables users to implement changes and measure impacts on latency, throughput, and cost with data-driven insights.

In summary, the introduction of Endpoint Candidates marks a significant improvement in how inference systems can be evaluated and optimized, helping organizations maximize their operational efficiency while maintaining quality across their deployments.
